🎯 Functional Correctness | 🟡 Minor | ⚡ Quick win

Preserve the self-distance clamp when norm products underflow.

For float inputs near 1e-12, a squared norm can be near 1e-24. Squaring that norm in norm_product underflows to zero. If a self-distance has a small positive round-off error, dist * dist can also underflow to zero. The comparison becomes 0 < 0, so neither epilogue clamps that self-distance. Compare the magnitude of dist against a tolerance scaled directly by the norm, without squaring either value. (github.com)

Update the self-distance clamp condition in this epilogue to compare the
magnitude of dist against a tolerance scaled directly by the norm, without
squaring dist or forming aNorm * bNorm. Preserve the aNorm == bNorm check and
clamp small positive round-off distances even when the norm product underflows.

Before this change, the clamp fired when ‖x‖² == ‖y‖² and d² · d² < eps, where eps is 1e-6 for float (get_clamp_precision). That is an absolute cutoff of |d²| < 1e-3, whatever the data scale, so 0.01 · I came out with every off-diagonal distance at 0 instead of 2e-4.

With equal norms s = ‖x‖² = ‖y‖², the condition is now |d²| < sqrt(eps) · min(1, s). That is 1e-3 · min(1, s) for float, ~3.2e-2 · min(1, s) for half and ~3.2e-8 · min(1, s) for double. For s ≥ 1 it is exactly the old cutoff. The round-off in s + s - 2⟨x, x⟩ scales with s, so true self-distances are still clamped when s < 1.

Question for reviewers: is a tolerance relative to ‖x‖² the right semantics here? I capped the scale at 1 so that large-norm data keeps today's absolute cutoff. A fully relative clamp would zero d² < 1e-3 · s, for example d² < 10 at s = 1e4, and that seemed too aggressive. Would you prefer a different form, such as one derived from machine epsilon and k? And do you know of any caller that relies on the old absolute clamp for small-magnitude data?

This is the epilogue of the CUTLASS fused 1-NN kernel (fused_l2_nn.cuh). The legacy backend choice picks that kernel on cc 8.x (legacy_top_1_nn_backend). Here is how spectral clustering reaches it:

  • spectral::detail::fit_predict runs kmeans::fit_predict on the row-major embedding.
  • The k-means assignment step calls top_1_nn (minClusterDistanceCompute.cu). The self-distance clamp matters here: a row whose norm is bitwise equal to a wrong centroid's norm got distance 0 to that centroid and won the argmin.

Brute-force kNN also applies this op directly, as a separate epilogue after the GEMM (knn_brute_force.cuh).

The same change in the SIMT epilogue. That epilogue is used by pairwise_distance (distance.cuh), the pre-SM80 fused 1-NN kernel (fused_l2_nn.cuh) and fused L2 kNN (fused_l2_knn.cuh). Every L2Expanded / L2SqrtExpanded caller goes through one of the two ops in this file. So the numerical change applies library-wide, but only to equal-norm pairs with ‖x‖² < 1.

Question for reviewers: the helper adds one multiply, one compare/select and one multiply per output element, in both epilogues. The PR has no benchmark numbers for this. Do you expect that to be measurable next to the GEMM main loop? If this is a concern, can someone run the pairwise-distance and fused 1-NN benchmarks (for example on A100, where the CUTLASS path is used) before merge?

This is the minimal reproducer from #2783. pairwise_distance on 0.01 · I returned 0 for every off-diagonal entry instead of 2e-4, and this test failed locally before the fix. The double case uses a scale of 1e-5 so that its d² = 2e-10 also falls under the old double cutoff (4e-20 < 1e-15). Both L2Expanded and L2SqrtExpanded are checked because they share the clamp.

This is the shape of the spectral failure at the top_1_nn level. There are 1000 rows and 5 centroids at 0.01 · e_j, all with equal norms, and every row has to pick its own centroid. The test loops over the CUTLASS backend (the one A100 k-means uses) and the unfused backend, and skips any backend that is_top_1_nn_backend_available reports as unavailable on the current GPU. So the CUTLASS case only runs on GPUs where that backend exists.
