The expanded L2 distance epilogues clamp round-off of self-distances to zero when the two norms are equal and the squared distance is below an absolute tolerance. For data with a small magnitude, this also zeroes the distances between distinct points with equal norms. Spectral embeddings of graphs with several connected components are such data, which made k-means (and spectral clustering) assign points to the wrong clusters on GPUs that use the CUTLASS fused 1-NN kernel. Scale the tolerance with the norms when they are smaller than one.

This fixes the flaky SpectralClusteringTestF.Result/7 (inputs) on arm64 / CUDA 12 / A100. All 17 historical CI hits are Result/7, with ARI 0.58-0.64. In the reproducer #2788 (run 38063875977), the full CLUSTER_TEST failed in 6/20 runs and Result/7 failed in 126/800 fresh processes.
- Root cause (analysis): the expanded-L2 epilogue zeroes a distance when the two squared norms are bitwise equal and
d² · d² < 1e-6(float). That tolerance is absolute. The spectral embedding of a 5-component graph puts each cluster at one point, all with the same squared norm (about 2.6e-4) and pairwised²of about 5.3e-4. So the k-means assignment can see distance 0 to a wrong centroid. On cc 8.x with CUDA 12, that assignment uses the CUTLASS fused 1-NN backend, which is why only A100 fails. - Fix: the tolerance is scaled by
min(1, ‖x‖²‖y‖²), so behavior for squared norms ≥ 1 is unchanged. There are new regression tests forpairwise_distanceandtop_1_nn. - Verification on the same A100 config (run 38067130759, summary): 0/800 and 0/20.

Before this change, the clamp fired when ‖x‖² == ‖y‖² and d² · d² < eps, where eps is 1e-6 for float (get_clamp_precision). That is an absolute cutoff of |d²| < 1e-3, whatever the data scale, so 0.01 · I came out with every off-diagonal distance at 0 instead of 2e-4.
With equal norms s = ‖x‖² = ‖y‖², the condition is now |d²| < sqrt(eps) · min(1, s). That is 1e-3 · min(1, s) for float, ~3.2e-2 · min(1, s) for half and ~3.2e-8 · min(1, s) for double. For s ≥ 1 it is exactly the old cutoff. The round-off in s + s - 2⟨x, x⟩ scales with s, so true self-distances are still clamped when s < 1.
Question for reviewers: is a tolerance relative to ‖x‖² the right semantics here? I capped the scale at 1 so that large-norm data keeps today's absolute cutoff. A fully relative clamp would zero d² < 1e-3 · s, for example d² < 10 at s = 1e4, and that seemed too aggressive. Would you prefer a different form, such as one derived from machine epsilon and k? And do you know of any caller that relies on the old absolute clamp for small-magnitude data?

This is the epilogue of the CUTLASS fused 1-NN kernel (fused_l2_nn.cuh). The legacy backend choice picks that kernel on cc 8.x (legacy_top_1_nn_backend). Here is how spectral clustering reaches it:
spectral::detail::fit_predictrunskmeans::fit_predicton the row-major embedding.- The k-means assignment step calls
top_1_nn(minClusterDistanceCompute.cu). The self-distance clamp matters here: a row whose norm is bitwise equal to a wrong centroid's norm got distance 0 to that centroid and won the argmin.
Brute-force kNN also applies this op directly, as a separate epilogue after the GEMM (knn_brute_force.cuh).

The same change in the SIMT epilogue. That epilogue is used by pairwise_distance (distance.cuh), the pre-SM80 fused 1-NN kernel (fused_l2_nn.cuh) and fused L2 kNN (fused_l2_knn.cuh). Every L2Expanded / L2SqrtExpanded caller goes through one of the two ops in this file. So the numerical change applies library-wide, but only to equal-norm pairs with ‖x‖² < 1.
Question for reviewers: the helper adds one multiply, one compare/select and one multiply per output element, in both epilogues. The PR has no benchmark numbers for this. Do you expect that to be measurable next to the GEMM main loop? If this is a concern, can someone run the pairwise-distance and fused 1-NN benchmarks (for example on A100, where the CUTLASS path is used) before merge?

This is the minimal reproducer from #2783. pairwise_distance on 0.01 · I returned 0 for every off-diagonal entry instead of 2e-4, and this test failed locally before the fix. The double case uses a scale of 1e-5 so that its d² = 2e-10 also falls under the old double cutoff (4e-20 < 1e-15). Both L2Expanded and L2SqrtExpanded are checked because they share the clamp.

This is the shape of the spectral failure at the top_1_nn level. There are 1000 rows and 5 centroids at 0.01 · e_j, all with equal norms, and every row has to pick its own centroid. The test loops over the CUTLASS backend (the one A100 k-means uses) and the unfused backend, and skips any backend that is_top_1_nn_backend_available reports as unavailable on the current GPU. So the CUTLASS case only runs on GPUs where that backend exists.

🎯 Functional Correctness | 🟡 Minor | ⚡ Quick win
Preserve the self-distance clamp when norm products underflow.
For float inputs near 1e-12, a squared norm can be near 1e-24. Squaring that norm in norm_product underflows to zero. If a self-distance has a small positive round-off error, dist * dist can also underflow to zero. The comparison becomes 0 < 0, so neither epilogue clamps that self-distance. Compare the magnitude of dist against a tolerance scaled directly by the norm, without squaring either value. (github.com)

…2841) Resolves #2094. Resolves #1632 This PR resolves the spectral clustering flaky test on ARM A100 cuda 12.2. It also solves the brute force returning wrong distances issue from #1632. When root-causing the issue, I found that running: our spectral embedding + sklearn kmeans works our spectral embedding + our kmeans doens't work It turns out that switching the backend of our kmeans from cutlass to the unfused path worked fine. The reason is that the cutlass path clamps distances to zero when the distances are below a certain threshold and the norms are equal. This can cause genuine small positive distances to be zero and in our case cause all points to be assigned to one cluster during spectral clustering. We should remove the clamping and only clamp if the distance is negative (since L2 distance can't be negative). This is consistent with how the other backends work. For instance, unfused and the new cutile 1nn path. I was able to reproduce locally on ARM A100 cuda 12.2 with and without this PR: Current main: fails around 5-8% of the time With this fix: passes 1000/1000 times. This PR achieves perfect ARI score of 1 for all the gtests. This wasn't generally the case before. ## Summary of changes * Remove equal-norm based clamping * For easily known self-neighbors like same X and Y inputs for pairwise_distances, set the diagonal to zero. * Add regression test (from flaky SpectralClustering scenario) from #2794 * When comparing self-neighbors (same vector against same vector) the distance will not be zero (because we are no longer clamping in this PR). Doing the sqrt on a small number will increase the error. We can loosen the threshold on the go test. We still expect the correct indices to be returned. * However, because we aren't aggressively clamping the distances, we can expect improved relative ordering between very close neighbors, which solves #1632. * The recommendation should be if users absolutely need self-neighbors to be zero, then they may run a processing step themselves to refine the distances from the set of returned neighbors (i.e. set same neighbors to be zero). * The changes in this PR affects the L2SqrtExpanded metric and codepaths for Kmeans (cutlass & legacy fused backend only), and brute_force. Other indexes like CAGRA and IVF-PQ during search time use their own distance kernels and not this path. * Aligns the L2SqrtExpanded clamp to be the same as the other kmeans backends like cutile and unfused. The expanded L2 distance epilogues (
l2_exp_cutlass_opandl2_exp_distance_op) set a distance to zero when the two squared norms are equal andd^2 < 1e-6(float). The clamp is meant to remove self-distance round-off, but the tolerance is absolute. With small-magnitude data, it also zeroes the distances between distinct points that have equal norms. For example,pairwise_distance(L2Expanded)on0.01 * Ireturns 0 instead of 2e-4.Spectral embeddings of graphs with several connected components look exactly like this: one point per component, all with the same norm, about 1e-2 in scale. As a result, k-means assigned rows to the wrong centroid on GPUs that use the CUTLASS fused 1-NN path (compute capability 8.x with CUDA 12; A100 in CI). That caused the flaky
SpectralClusteringTestF.Result/7.This PR scales the tolerance with the norms when they are below 1, so behavior for norms of 1 or more is unchanged. It also adds regression tests for
